AI engineering for finance & insurance in Berlin: a deep dive

Berlin is fertile ground for FinTech innovation, but it is also tightly regulated and risk-aware. For financial and insurance companies this means: AI must not only perform, it must above all be legally compliant, auditable and robust against manipulation. AI engineering in this environment requires a combination of software engineering, MLOps, compliance architecture and product-oriented development.

Technically, everything starts with choosing the right architecture. For LLM-based systems such as advisory copilots or risk assessments we recommend modular architectures: clearly separated components for inference, context management, auditing and access control. This separation allows each area to be tested, scaled and monitored independently.

Compliance doesn’t start with model choice, it starts with data intake. Relevant data must be classified, minimized and pseudonymized before being used for training or inference. Clear data lineage and documented consent processes ensure auditors can trace the path of every decision.

On the technical level, audit logs, explainability modules and versioning are central: every model deployment should have a traceable history, distinguish between train, test and production versions and include documented metrics. That way it’s always possible to explain why a model gave a certain recommendation.

Organizationally, governance boards with compliance, security and business representatives are necessary. These boards define SLOs, escalation processes and regular review meetings. Involving legal and compliance teams from the start prevents later rework and costly recalls.

Practical measures include regular penetration tests, Data Protection Impact Assessments (DPIAs) and implementing data minimization. For highly regulated use cases we often recommend self-hosted or on-prem deployments to retain full control over data flows and storage locations.

Sensitive data can be used, but only within a stringent security and governance framework. This begins with access control, encryption at rest and in transit and separate environments for development, testing and production. Not all LLM interactions need to use external models — private, hostable models are an option.

For many insurance use cases we recommend No-RAG designs or tightly controlled retrieval pipelines. This prevents sensitive context from ending up uncontrolled in model prompts or persisting in external systems. If retrieval is necessary, it should be done with a local vector store like pgvector behind controlled firewalls.

Another lever is input sanitization and redaction: personally identifiable data is masked or pseudonymized before inference. Query-level policies also help by preventing certain types of requests from ever reaching model instances.

Finally, contractual and process mechanisms are important: data processing agreements, clear SLAs with cloud or model providers and regular audits ensure that technical measures are backed by contractual and organizational safeguards.

A clear, realistic timeframe usually breaks into three phases: PoC (4–6 weeks), MVP/pilot (2–3 months) and a staged production rollout (a further 2–6 months). The actual duration depends on data availability, integration complexity and regulatory reviews. KYC or AML processes often require additional compliance review time.

We recommend starting with a focused PoC that tests a core hypothesis: does the model work technically? Can the integration be implemented? Is the value measurable? A lean PoC reduces risk and cost before larger integrations proceed.

The MVP should simulate production-like conditions: real data streams, load tests and monitoring baselines. In this phase production aspects such as rollback strategies, cost management and alerting are implemented. Only once this foundation is in place is a staged rollout advisable.

It’s important that timelines include buffers for governance reviews and external audits. Early alignment with compliance shortens later waiting times and prevents rework that could significantly extend the project.

For companies with strict data protection requirements, hybrid or fully self-hosted deployments are recommended. A proven combination is using Hetzner as cost-efficient infrastructure, combined with MinIO for object storage and Traefik for ingress management. Coolify simplifies deployment and service orchestration.

Orchestrating batch and real-time workloads is important: models must be inferred performantly while data pipelines handle ETL tasks. We rely on Kubernetes for scalability, paired with MLOps tools for model versioning, monitoring and automated testing.

For knowledge systems we use Postgres + pgvector as a reliable, performant and scalable solution for vector storage. This enables fast local retrievals without external calls and is ideal for sensitive knowledge workloads.

Finally, cost management is critical: GPU instances should be used strategically for inference peaks while CPU-based workloads can run more cheaply. Auto-scaling, spot instances and strict quota management prevent unexpected cost spikes.

KYC/AML processes are well suited to automation because many steps are rule-based or document-based. AI can handle document analysis, entity extraction and initial scoring stages. This reduces manual review workloads and accelerates onboarding times.

Important is the combination of heuristic rules and probabilistic models: a rule-based front end filters clearly defined cases while models escalate ambiguous cases to human reviewers. This keeps decision responsibility with humans in critical cases.

Another lever is continuous feedback: cases corrected by humans must flow back into training and monitoring pipelines to reduce drift and improve precision. Only in this way does the system remain reliable over time.

Practical implementation requires close coordination with compliance teams, defined thresholds for escalation and transparent documentation of all model decisions — a framework that simplifies regulatory audits while delivering efficiency gains.

Integration starts with a clear API strategy: AI components should be accessed via defined, versioned interfaces. Transactional processes require idempotent operations and clear error paths so automation does not create inconsistencies in core systems.

Another aspect is asynchronous processing: not all AI tasks need to run synchronously. Batch processing or event-driven architectures reduce latency demands on core systems and allow robust retry strategies.

For legacy systems adapter layers are often necessary. These translators encapsulate old interfaces and translate them into modern API calls so AI services can be developed independently. Feature stores and message brokers also help decouple systems.

For operations, monitoring, end-to-end tests and SLOs are essential. Only then can you ensure an AI service not only works technically but remains reliable in tandem with critical business systems.
